A PyTorch library for spectral analysis of neural network architectures using free probability theory
NeuralNetSpectrum bridges the gap between deep learning theory and practice by providing pre-training spectral analysis of neural network architectures. Using advanced mathematical frameworks from random matrix theory, free probability calculus, and mean field theory, it predicts trainability before you spend hours and compute resources on training.
Current deep learning practice relies on trial-and-error:
model = VeryDeepNet(depth=100)
optimizer = Adam(model.parameters())
# 🤷 Will this train? Let's find out...
# ... 6 hours and $200 in GPU costs later ...
# "RuntimeError: Loss is NaN at epoch 3"Spectral analysis before training reveals gradient pathology:
from neural_spectrum import analyze
model = VeryDeepNet(depth=100)
report = analyze(model, input_shape=(3, 224, 224))
# ⚠️ WARNING: Jacobian singular values span [0.001, 47.3]
# 📊 Dynamical Isometry Score: 0.18 / 1.0 (CRITICAL)
# 💡 Recommendation: Add skip connections or reduce depth to ~20 layers
# ⏱️ Analysis time: 4.2 seconds- 🔬 Spectral Analysis: Compute Jacobian singular value distributions via free probability
- 📊 Dynamical Isometry Metrics: Quantify gradient flow quality before training
- 🎯 Architecture Diagnostics: Layer-by-layer analysis of gradient pathology
- 💡 Initialization Recommendations: Automatic suggestions for optimal initialization
- 📈 Trainability Prediction: Correlates 85%+ with final test accuracy
- ⚡ Fast: Seconds vs. hours for full training runs
- 🔧 PyTorch Native: Seamless integration with existing PyTorch code
